The Challenge

The client—a Fortune 500 retailer operating more than 800 store locations and a growing e-commerce channel—had been managing inventory through a combination of buyer intuition, seasonal trend spreadsheets, and a decade-old ERP system that hadn’t been meaningfully updated since its implementation.

The results were costly. At any given time, 18-22% of SKUs were in an overstock position, tying up capital and requiring markdowns. Simultaneously, high-velocity items routinely hit zero inventory at regional distribution centers, causing stockouts that affected customer satisfaction and drove shoppers to competitors. The combined impact was estimated at $12M annually in lost margin.

The root problem was forecasting. The existing process gave buyers aggregate-level demand signals but couldn’t account for regional variation, weather patterns, promotional lift, or the increasing unpredictability introduced by supply chain disruptions post-2020. Buyers were making $50,000+ inventory decisions with data that was often two weeks stale.

Our Approach

We began with a 6-week discovery phase focused on data archaeology—understanding what data existed, what quality it was, and what was actually driving inventory decisions day-to-day. This surfaced several important findings:

  • The client had five years of clean point-of-sale data at the SKU/store level, largely unused for forecasting
  • Regional distribution center data was siloed from the central ERP and never aggregated for analysis
  • Buyers had developed workarounds (separate Excel models, personal rule-of-thumb adjustments) that captured institutional knowledge but weren’t scalable or transferable

Rather than proposing a big-bang replacement, we designed a phased approach: build a working proof-of-concept on a single product category, validate the model against historical data, then expand.

The Solution

The predictive inventory system was built in three layers:

Data infrastructure: We built a real-time data pipeline using Apache Kafka to consolidate POS data, distribution center inventory levels, vendor lead times, and external signals (weather, local events, promotional calendars) into a single PostgreSQL data warehouse. This solved the fragmentation problem and gave the model fresh data rather than stale weekly reports.

Forecasting models: Using scikit-learn and AWS SageMaker, we developed an ensemble of forecasting models—a gradient boosting model for baseline demand, a separate model for promotional lift, and a time-series model for seasonal patterns. The ensemble approach significantly outperformed any single model in backtesting against historical data. Forecast accuracy jumped from 71% to 94% on the pilot category.

Decision support interface: We built a Tableau dashboard that surfaced model recommendations directly to buyers, with explainability features showing why the model recommended a specific order quantity. Critically, buyers retained final decision authority—the system made recommendations, not mandates. This was essential for adoption.

Results

After an 8-month engagement, the system was fully deployed across all product categories and integrated into the weekly buying workflow.

Buyer adoption was higher than projected. The decision to keep humans in the loop—with the AI as advisor rather than decision-maker—proved correct. Buyers reported spending less time on data gathering and more time on strategic vendor relationships and category development.

Lessons Learned

Data quality is the real project. The technical modeling work was less than 30% of the total engagement time. The majority was spent cleaning, consolidating, and documenting data sources that had never been integrated. This is almost universally true in enterprise AI projects and is consistently underestimated in initial scoping.

Start with one category. The temptation to boil the ocean is real. Building the system on a single product category first gave us a contained environment to find and fix edge cases before they affected the whole business. It also gave skeptical stakeholders a concrete proof point to evaluate.

Explainability drives adoption. Buyers trusted the system significantly more once they could see why it was making a recommendation. A black-box model—even an accurate one—generates resistance. The investment in explainability features paid for itself in adoption speed alone.

Define success metrics before you start. We agreed on the baseline metrics and target outcomes before writing a line of code. This made the final business case conversation straightforward rather than contested.
